1. The Streaming Model: Data as a Fleeting Resource
In the standard streaming model, the input is a sequence of (m) items (\sigma = (a_1, a_2, \ldots, a_m)) drawn from a universe ([n] = {1, \ldots, n}). The algorithm reads the items one by one, maintaining a summary (a sketch) of size polylogarithmic in (n) and (m). After processing the stream, the algorithm outputs an approximation to some function of the frequency vector (f = (f_1, \ldots, f_n)), where (f_i) is the number of occurrences of item (i).
The model has several variants: the cash register model (items are inserted), the turnstile model (items can be inserted and deleted, so frequencies can be negative), and the sliding window model (only the most recent (W) items matter). The turnstile model is the most general and challenging, requiring sketches that are linear—that can handle both additions and subtractions. Linearity means the sketch of the combined frequency vector is the sum of sketches of individual updates, which is essential for distributed monitoring where multiple streams must be aggregated.
2. The Misra-Gries Algorithm for Frequent Items
The Misra-Gries algorithm (1982), rediscovered by Demaine, López-Ortiz, and Munro (2002) as “Frequent,” solves the heavy hitters problem: find all items whose frequency exceeds a fraction (\phi) of the total stream length. The algorithm maintains a map from items to counters, with at most (k = 1/\phi) entries at any time.
When an item arrives, if it is already in the map, increment its counter. If not, and the map has fewer than (k) entries, add it with count 1. If the map is full, decrement all counters by 1, and remove entries whose counter reaches zero. This “decrement-all” step is the key: items that never reach frequency (\phi m) will eventually be eliminated. The algorithm guarantees that any item with true frequency above (\phi m) is in the final map, and the estimated frequency is at most the true frequency and at least the true frequency minus (\phi m).

The pointwise minimum across rows is the genius of Count-Min: collisions in one row may inflate the estimate, but across independent rows, the minimum of several overestimates is a better estimate. Markov’s inequality bounds the probability that the error exceeds (\epsilon |f|_1) by (e^{-d} = \delta). The space is (O(\frac{1}{\epsilon} \log \frac{1}{\delta} \log n)) bits—sublinear in (n) when (\epsilon) and (\delta) are constants.

The Flajolet-Martin sketch (1985), refined as HyperLogLog (Flajolet, Fusy, Gandouet, Meunier, 2007), achieves remarkable accuracy with tiny space: estimating cardinalities up to (10^9) with 2% error using only 1.5 KB.
The idea: hash each element to a uniform random bit string. Observe the position of the least significant 1-bit (or, more commonly, the number of leading zeros). If the stream has (D) distinct elements, the maximum observed leading-zero count is roughly (\log_2 D). Specifically, the probability that all (D) elements hash to a value with at most (b) leading zeros is ((1 - 2^{-b-1})^D \approx e^{-D/2^{b+1}}), which transitions from near-0 to near-1 as (D) passes (2^b).
Flajolet-Martin uses stochastic averaging: partition the stream into (m) buckets by the first few bits of the hash, compute the maximum leading-zero count in each bucket, and take the harmonic mean. HyperLogLog refines this with bias correction and achieves error (1.04 / \sqrt{m}). With (m = 2048) buckets (occupying about 1.5 KB for 5-bit counters), the relative error is about 2%. The HyperLogLog sketch is additive (the sketch of the union of two sets is the element-wise maximum of their sketches), enabling distributed cardinality estimation across multiple machines.

8. Turnstile Streams and Linear Sketches
In the turnstile model, updates can be both positive and negative: an item’s frequency can decrease as well as increase. This models settings where the stream records net changes, such as database transactions (insertions and deletions) or graph streams where edges are added and removed. A sketch is linear if the sketch of the sum of two frequency vectors equals the sum of their sketches: (\text{sketch}(f + g) = \text{sketch}(f) + \text{sketch}(g)).
Linearity is crucial for the turnstile model because it allows the sketch to handle deletions by subtracting the deleted item’s contribution. Count-Min and Count-Sketch are linear because updates are additions to counter arrays. The AMS sketch for (F_2) is linear because the estimator is a linear function of the stream.
The power of linear sketches extends to graph streams: to estimate the number of triangles in a graph stream where edges appear and disappear, a linear sketch of the edge incidence vectors can be combined with the Alon-Matias-Szegedy triangle counting algorithm. Linear sketches also enable “composable” processing: multiple independent sketches can be combined to estimate properties of the union of streams, without centralizing the raw data.
9. Sliding Windows and Exponential Histograms
In many applications, only recent data matters. The sliding window model restricts attention to the most recent (W) items. The challenge: as items age out of the window, their contributions must be deducted from the sketch. The exponential histogram technique (Datar, Gionis, Indyk, Motwani, 2002) solves this by maintaining a series of buckets whose sizes grow exponentially, with the oldest bucket possibly partially expired.
To estimate the number of 1s in a sliding window of a bit stream, the exponential histogram algorithm maintains buckets that each store the size and timestamp of a contiguous block of 1s. Bucket sizes are powers of 2; there are at most two buckets of each size. As bits arrive, the algorithm updates buckets; when the oldest bucket falls outside the window, it is dropped. The estimate is the sum of bucket sizes, minus half the oldest bucket (to account for partial overlap with the window). The Alon-Matias-Szegedy triangle counting sketch generalizes to counting arbitrary subgraphs using higher-order moments of edge incidence vectors. Maximum matching in graph streams is another central problem. The Johnson-Lindenstrauss (JL) lemma (1984) states that any set of (n) points in (d)-dimensional Euclidean space can be embedded into (O((\log n)/\epsilon^2)) dimensions while preserving all pairwise distances within a factor of ((1 \pm \epsilon)). The embedding is a random linear projection—multiply the data matrix by a random matrix.

Standard randomized sketches fail catastrophically in this setting because the adversary can learn the random hash functions from the outputs and exploit them.
Ben-Eliezer, Jayram, Woodruff, and Yogev (2020) introduced adversarially robust streaming. The key technique: periodically refresh the random hash functions and reconstruct the sketch from scratch using the current prefix of the stream (which is known and fixed).
