The DP recurrence:

Not trivial. The state space is O(n^3) and each state considers O(n^2) split pairs, leading to O(n^5) naive. However, similar to OBST, there may be monotonicity properties (like quadrangle inequality) that reduce complexity, but they are less studied. For small to moderate n (up to a few hundred), we can compute exactly. For large n, we need heuristics.

5.3 Heuristic Approaches

A practical alternative: use a greedy algorithm that approximates Huffman coding but respects the inorder constraint. For binary search, a well-known heuristic is the “median-of-three” or “probability-weighted median”. For ternary search, we can choose split points based on cumulative probability: find the smallest i such that cumulative sum up to i exceeds 1/3 of total probability, and similarly for 2/3. This creates a tree that roughly balances the total probability across three children, which is optimal under equal probabilities but may not be optimal for arbitrary distributions. However, if we want to minimize expected comparisons, we should actually try to make the high-probability keys as shallow as possible, even if that means the middle child has very low probability. So a better heuristic is to place the two split points symmetrically around the highest probability region. For a distribution that is monotonically decreasing (e.g., exponential with small λ where probability concentrated at left), we might put the first split point very near the left (so that left child is tiny but high probability), and the second split further right.

We can also use dynamic programming with a sliding window or using monotone matrix search to reduce complexity to O(n^2) or O(n log n) for certain cost functions.

5.4 Brief Comparison of Expected Depths

We can compute the lower bound on expected comparisons for any decision tree under the sorted constraint. This bound is given by the Shannon entropy of the distribution divided by the information gain per comparison. But the constraint may increase the minimal expected comparisons.

For binary search trees, the optimal expected cost is no less than the entropy H(p) (since each comparison yields at most 1 bit), but can be larger. For ternary search trees, the lower bound is H(p) / (log2(3)/2) ≈ 1.26 H(p). So even if we had an unconstrained ternary tree, we cannot beat this factor. However, the ordering constraint might hurt binary more than ternary? Possibly but we need to test.

In practice, for many real distributions, the entropy H(p) is small (e.g., high skew). For a Zipf with s=1 and n=1000, H(p) ≈ ln(1000)/2? Actually Zipf(1) normalized: Harmonic number H_n ~ ln n + γ, probabilities p_i = 1/(i H_n). Entropy = -Σ p_i log2 p_i = log2(H_n) + (1/H_n) Σ (log2 i)/i. Approx for large n: H_n ~ ln n, and Σ log i / i ~ (1/2)(ln n)^2. So entropy ~ (1/2) log2 n (roughly). For n=1e6, log2 n=20, entropy ~10 bits. Optimal binary tree under ordering might be close to that. Ternary lower bound ~12.6 bits, so ternary may be slightly worse even in best case. But can we actually achieve the lower bound? With constrained trees, binary might not achieve entropy either. The gap might be in favor of ternary for some distributions? We need experiments.

6. Why Ternary Search Might Help: Theoretical Arguments

6.1 Flexibility of Three-Way Splits

The main advantage of ternary search is that it can concentrate high probability in one child more aggressively than binary. Consider a distribution where the most likely key is at position 0 (the smallest key) with probability p0 = 0.5. The rest of the keys are uniformly distributed. For binary search, the root must be some key. If we set root to be the median, then the left subtree contains about half of the keys, including the most likely key at depth 2 or more (since root is median, left child’s root is the median of left half, etc.). To place the most likely key at the root, we could choose root = key 0. Then the left subtree is empty, and the right subtree contains all other keys. But then the tree is extremely unbalanced: the root node’s left child is a leaf (unsuccessful for keys less than 0) or a special case. The right child is a large subtree. The expected comparisons: p0 _ 1 (since root key equals target) + (1-p0) _ (1 + expected cost of right subtree). For uniform remaining keys, the right subtree is still a sorted array, and we can build an optimal BST for it. This is exactly the OBST solution: the root should be the key that minimizes the cost. The cost for root = key 0: left empty cost 0, right problem size n-1 with total probability 0.5. The expected comparisons = 0.51 + 0.5(1 + cost_right). cost_right is the optimal expected cost for n-1 keys with uniform probabilities (since remaining probability is uniform). This cost_right is about log2(n-1) - 1 ~ log2 n. So total ~ 1 + 0.5 * log2 n. If root is median (key n/2), then left subtree has n/2 keys with total prob 0.5 (assuming uniform plus the high prob key? Wait p0 is 0.5 and that key is in left subtree if root >0. The left subtree probability = 0.5 (for key0) + sum of uniform probabilities for other keys in left half. The total prob of left subtree could be >0.5. The root comparison costs 1 for all queries. After that, recursively. The optimal might still be root=0 to keep the high prob key shallow. So binary can achieve that.

Now consider ternary search. With root containing two split points, we can place the most likely key as, say, the left split point (mid1) at depth 1. Then for queries of that key, we need only one comparison (since we check mid1 first). For other keys, we need at least 2 comparisons at root. But we also have three children. For the most likely key at position 0, we can make the left child empty (range empty) and the middle child contain all other keys? Not exactly: if mid1 is key0, then after comparing with mid1, if target < mid1? That’s impossible (since it’s the smallest). So we can arrange the splits such that key0 is mid1, and the left child is never taken (empty). The middle child contains keys between mid1 and mid2 (which could include the next few keys), and the right child contains keys from mid2+1 onward. This still gives three branches, but one branch (left) is never used. So it’s no better than binary with root=key0 (which has 2 branches). However, ternary search requires a second split point mid2. If we set mid2 far away, the middle child could contain a small set of keys; if high probability keys are concentrated near 0, we could put them all in middle child (between mid1 and mid2), so they are reached after 2 comparisons (first fails with mid1, then succeeds with mid2?) Actually if target equals mid2, 2 comparisons. But if target is between mid1 and mid2, then after two comparisons we branch to middle child and continue. So the cost for those keys is at least 2 + further steps. That might be worse than binary where we could have root=key0 and then for the next key (key1) as left child of root? Wait, binary tree with root=key0: then for key1, it would be in the right subtree. We would compare with root (key0), not equal, then go right, then recursively search. The root comparison counts 1, then we need others. So key1 cost = 1 + cost_right_subtree. That could be better than ternary’s 2 + cost_middle_subtree if cost_right_subtree ≈ cost_middle_subtree. So binary may still win.

But ternary can have three children, so if there are multiple high-probability keys, we can assign them to separate branches, potentially reducing depth for high-probability clusters better than binary. For example, imagine two high-probability keys at positions 0 and n-1 (both ends). Binary search: either key0 or key n-1 can be root, but not both. If root is median, both ends are deep. If root is key0, key n-1 is deep in right subtree. With ternary, we could set split points at key0 (mid1) and key n-1 (mid2). Then left child empty, middle child contains all others (low probability), right child empty. Both high-prob keys have cost 1 or 2 (mid1 cost 1, mid2 cost 2). So expected cost ~0.51 + 0.52 = 1.5, which is great. Binary could achieve similar by having two roots? Not possible because binary tree has only two children. So ternary’s three-way split allows handling two extreme keys as split points simultaneously. More generally, ternary can have two “immediate” keys at the root, potentially doubling the number of keys that can be found with very few comparisons. For binary, at the root you can only get one key as the root itself. For ternary, you get two keys as split points, each of which can be found with 1 or 2 comparisons. So if there are many high-probability keys, ternary can spread them across multiple nodes but at the cost of extra comparisons at deeper levels.

6.2 Decision Tree Depth vs Information Gain

Each ternary node yields up to 3 outcomes, but uses 2 comparisons. The information-theoretic efficiency is lower. However, in terms of expected number of comparisons, the gain from placing two high-prob keys at shallow depth may outweigh the inefficiency if the distribution has many keys with moderate probability. This is a trade-off.

6.3 A Simplified Model

Assume we have a set of keys with probabilities following a power law. Consider building a decision tree where we aim to minimize expected weighted depth, where depth is measured in number of comparisons. For a ternary node, the cost to reach any of its two split points is 1 or 2 comparisons; to reach a key in one of its child subtrees, the cost is 2 plus the subtree depth. For a binary node, the cost to reach its one split point is 1; to reach keys in children, cost is 1 plus subtree depth. So binary seems better per level. However, ternary can have twice as many “free” keys per level (two split points vs one) at the cost of an extra comparison for the second split point. For a heavy-tailed distribution, if you can capture the top few probabilities with split points, you get low cost. For example, if the top key probability is 0.4, second top is 0.3, you could put them as split points at root: expected cost = 0.41 + 0.32 + remaining2 = 0.4 + 0.6 + 0.6 = 1.6. With binary, you can only put one at root. Suppose you put top key at root: cost = 0.41 + (0.3+0.3)_ (1 + cost_remaining). cost_remaining for two keys? Approximately 1.5 average? So total = 0.4 + 0.6_(2.5) = 0.4+1.5=1.9. So ternary wins in this toy example. But this depends on the ability to place second top as mid2 (cost 2). If the second top is not near the extremes, you might need to put it deeper.

Thus, ternary search can be beneficial when the distribution has a small number of very high-probability keys that can be placed as the two split points at the root. More generally, we can think of constructing a ternary search tree that places high-probability keys as close to the root as possible, using the two split points per node. For binary search, each node only has one “free” slot per node.

6.4 Impact of Ordering Constraint

The ordering constraint limits which keys can be split points together. At the root, the two split points must be in sorted order, say at positions i and j (i<j). Then left child contains keys < i, middle child keys between i and j, right child keys > j. So the keys at positions i and j become the “fast” keys. If the high-probability keys are clustered at the ends of the array, they can be chosen together. If they are spread throughout the array, you cannot choose both as root because they would not be both near ends? Actually you could choose any two keys; but then the three ranges might be large. For example, if top key is at position 0, second top at position 500 (out of 1000), then root splits into left empty, middle [1..499], right [501..999]. The second top (position 500) is mid2, cost 2. The middle child contains many keys but low total probability; the right child contains the rest. This might be okay.

6.5 Expected Cost Bound

For a given probability distribution, we can compute the minimum expected cost of a ternary search tree (with two comparisons per node). This is analogous to the optimal binary search tree but with three children. There is no known closed-form for the general case, but we can compute using DP for moderate n and compare.

7. Experimental Evaluation

7.1 Setup

We implement:

  • Standard binary search (balanced, always median split).
  • Standard ternary search with equal splits (1/3, 2/3).
  • Optimized binary search tree (OBST) using Knuth’s DP (n up to 500 due to O(n^2) memory).
  • Optimized ternary search tree (OTST) using our own DP (n up to 200 due to O(n^5) naive, but we use a heuristic with monotonicity to reduce to O(n^3) or O(n^2)? For simplicity, we use a greedy heuristic: choose root splits that minimize expected cost assuming subtrees are balanced. We’ll call it “heuristic ternary”.

We test on synthetic distributions:

  1. Uniform (n=1024) – sanity check.
  2. Exponential: p[i] = C * exp(-0.01*i) for i=0..1023.
  3. Zipf exponent s=1.0 and s=1.5.
  4. Bi-modal: two Gaussian clusters at 20% and 80% of the range.

We measure average number of comparisons (not counting the final equality? We’ll count total comparisons including equality checks). For each algorithm, we run 100,000 random queries according to the distribution and compute average.

7.2 Results (Simulated)

I will simulate with Python and produce approximate numbers. For now, I’ll reason theoretically.

Uniform (n=1024):

  • Binary balanced: avg comparisons ~ 9.0 (as earlier).
  • Ternary equal splits: avg ~ 2log3(1024) - c ~ 26.29 - 1 = 11.58 (est). So binary wins.
  • OBST also yields ~9.0 because uniform leads to balanced tree.
  • Heuristic ternary: likely similar to equal splits.

Exponential (n=1024, decay 0.01): Probability sum normalization: p[i] = exp(-0.01*i)/S, S ~ 100. The first key has probability ~0.0095? Actually let’s compute: exp(0)=1, sum_{i=0}^{1023} exp(-0.01i) ≈ (1 - exp(-10.23))/(1 - exp(-0.01)) ≈ (0.9999)/(0.00995) ≈ 100.5. So p[0]=1/100.5≈0.00995. That’s not heavy skew. More aggressive: decay 0.1: sum ~ (1 - exp(-102.3))/(0.095) ≈ 10.5, p[0]≈0.095. Still moderate. Let’s use decay 0.5: sum ~ (1 - exp(-511.5))/(0.393) ≈ 2.54, p[0]≈0.393. That’s heavy skew: first key ~39%, second ~23.8% (exp(-0.5)=0.6065 * residual? Actually probabilities: p[0]=exp(0)/sum=1/2.54=0.394, p[1]=exp(-0.5)/2.54=0.6065/2.54=0.239, p[2]=0.3679/2.54=0.145, etc. So top 3 keys have >75% probability.

Under this distribution:

  • Binary balanced: expected comparisons? The first key (prob 0.394) is at depth approx log2(1024)-? The median is at index 512, so first key is at leftmost leaf of left subtree. In balanced BST, the leftmost leaf depth is about log2 n =10. So key0 cost ~10 comparisons. That’s terrible. Expected = sum p_i*depth_i. High prob keys have high depth, low prob keys have low depth? Actually the tree is symmetric: keys near median have low depth, keys at ends have high depth. So expected comparison may be high because high prob keys are at ends. Possibly around 8-9? Actually average depth over all keys is 9, but weighted by high prob ends, expected might be a bit higher, say 9.5.

  • OBST: Optimal binary search tree will put the high prob keys near root. The optimal root might be key0? Let’s compute: if root is key0, then left child empty, right subtree contains keys 1..1023 with total probability 0.606. The cost = p01 + (1-p0)(1 + costright). cost_right is OBST for remaining keys with renormalized probabilities. That is likely efficient. The cost might be around 1 + 0.606 (optimal cost for n-1). Approximately: For uniform remaining, costright ~ log2(1023) -1 ≈ 9. So total ~ 1 + 0.6069 = 6.45. But we can do even better by using a root that is not key0 but maybe key1? Let’s compute using DP: For n=1024, constructing full OBST is heavy, but we can approximate. The optimal root often is the key that balances total probability (like median of cum prob). The cumulative probability from left: key0 alone has 0.394; key1 alone 0.239; cumulative to key1 = 0.633. The median of probability (50% point) lies at key1. So root could be key1. Then left subtree contains key0 only (prob 0.394), right subtree keys 2..1023 with total prob 0.367. cost = p11 + (p_left)(1 + costleft) + (p_right)(1 + costright). cost_left for single key is 1, so left branch cost = 0.394(1+1)=0.788. right branch: p_right=0.367, cost_right for remaining 1022 keys with scaled probabilities. Roughly similar to uniform: cost_right ~ log2(1022)-1 ≈ 9. So right branch cost = 0.367*(1+9)=3.67. plus root cost (p1*1) = 0.239. Total = 0.239 + 0.788 + 3.67 = 4.697. That’s better than 6.45. So OBST can achieve expected comparisons around 4.7. This is far better than binary balanced.

  • Ternary equal splits: same as uniform case, expected comparisons ~11.6. Even worse than binary balanced. So equal-split ternary loses badly.

  • Heuristic ternary (greedy with weighted splits): We can choose split points to group high prob at left. For example, choose mid1 = key0, mid2 = key1. Then left empty, middle contains? Between key0 and key1 there are no keys (since consecutive) so middle empty. Right contains keys 2..1023 probability 0.367. For queries: key0 cost 1, key1 cost 2 (since first comparison fails, second succeeds), others cost 2 + recursive cost. Expected cost = 0.3941 + 0.2392 + 0.367*(2 + cost_right). cost_right for right subtree (keys 2..1023) with scaled probabilities (uniform now? Not exactly, but after removing high two, remaining distribution is still exponential but without the first two). The cost_right can be optimized further (we could recursively apply ternary). Let’s approximate cost_right similarly: for remaining n-2 keys, we can again choose mid1=key2, mid2=key3, etc., creating a “cascading” ternary tree that handles the top two keys at each level. This is essentially building a ternary tree where each node’s split points are the two highest-probability remaining keys at the ends (if they are at ends). For exponential distribution, the high prob keys are in order, so we can peel them off sequentially. The tree becomes a degenerate right-leaning tree. The expected cost for this heuristic can be computed: At root, process two keys (cost 1 and 2). Then the remaining probability goes to right child, which again processes next two keys, etc. This is similar to using a ternary tree to encode a sequence of keys with decreasing probability. The expected cost per key depends on its rank. For key rank r (0-indexed), it will be processed at node depth floor(r/2). If r even (first of pair): cost = 2depth + 1 (since compares at all ancestor nodes: 2 per ancestor, plus 1 at own node). If r odd: cost = 2depth + 2 (since first split fails, second succeeds). For exponential decay with p_r = c * exp(-0.5 r), the total expected cost = sum*{r even} p_r*(2*(r/2)+1) + sum*{r odd} p_r*(2*(floor(r/2))+2). For large n, this sum converges. Let’s estimate: p_0=0.394, p_1=0.239, p_2=0.145, p_3=0.088, p_4=0.053, … depth0 for r=0: cost=1; r=1: cost=2; depth1 for r=2: 21+1=3; r=3: 21+2=4; etc. So expected = 0.3941 + 0.2392 + 0.1453 + 0.0884 + 0.053*5 + … ≈ 0.394 + 0.478 + 0.435 + 0.352 + 0.265 + … = approx 1.924 for first 5, plus tail ~ maybe 2.5 total? That’s very low! Compared to OBST’s 4.7, ternary heuristic gives ~2.5 expected comparisons. That’s a huge win. But is this realistic? The issue is that the heuristic requires the high-probability keys to be consecutive and at the array ends. In an exponential distribution with decay from start, the high prob keys are in order at the beginning. So this works. For other distributions, like Zipf where probabilities decrease slowly, the top keys may not be consecutive: e.g., key 0: 0.07, key1: 0.05, key2: 0.04, … but they are still in order of index (if sorted by key, the probabilities are arbitrary). However, Zipf is defined by rank, not by key value. If we sort the array by key, the query probability for each key is not necessarily decreasing in key order. For example, in e-commerce, product IDs are sequential, but popular products can be anywhere. So the probabilities are not monotonic in the sorted order. This breaks the heuristic that high-prob keys are at ends. Ternary search can still place two high-prob keys as split points, but they might not be at the ends; they may be somewhere in the middle, creating three non-empty children. The advantage is less clear.

Thus, we need to test on distributions where probabilities are arbitrary, not just decreasing.

We’ll simulate with a synthetic Zipf where probabilities are assigned to keys in random order. For n=1024, generate random permutation of keys, assign Zipf probabilities according to rank (i.e., rank 1 gets highest prob, but mapped to a random key). Then compute expected comparisons for each algorithm.

7.3 Expected Results Discussion

Due to the complexity of full simulation here, I will summarize likely outcomes:

  • For uniform distribution, binary search (balanced) is best.
  • For distributions with strong skew localized to one end of the array (e.g., exponential decay from left), the heuristic ternary search that peels off high-prob keys in pairs can achieve lower expected comparisons than OBST, because it captures two keys per level instead of one. The OBST can also capture one key per level, but binary tree’s expected cost is roughly H(p) (entropy) while ternary’s lower bound is 1.26 H(p). So if H(p) is small (high skew), ternary might beat binary despite the constant factor? Actually for exponential with high skew, H(p) is small. Let’s compute entropy for our example: p0=0.394, p1=0.239, p2=0.145, p3=0.088, p4=0.053, rest small. H = -Σ pi log2 p_i ≈ 0.3941.34 + 0.2392.06 + 0.1452.79 + 0.0883.51 + 0.0534.23 ≈ 0.528 + 0.492 + 0.404 + 0.309 + 0.224 = 1.957 bits. That’s the lower bound for binary (if we could achieve entropy). OBST achieved ~4.7 comparisons, which is far above entropy due to ordering constraint. Ternary heuristic got ~2.5 comparisons, which is 1.261.957 = 2.47, essentially hitting the theoretical lower bound! So the ternary heuristic nearly achieves the lower bound because the distribution is such that high-prob keys are consecutive and can be efficiently encoded by a degenerate tree where each node processes two keys. The ordering constraint is not a problem because the tree is a right-leaning chain. This suggests that for _monotonic decreasing probability in the sorted order, ternary search can approach the information-theoretic limit, while binary search cannot due to its two-way splits (which waste one branch). This is a strong argument.

For arbitrary probability assignments (random permutation of probabilities), the ordering constraint prevents such efficient concentration. OBST can still do well by placing high-prob keys near root, but ternary might have advantages for distributions with two high-prob keys that are far apart (e.g., at both ends). In general, the benefits are nuanced and depend on the specific distribution.

7.4 Real-World Data Experiment

We could also test on a real dataset from an e-commerce search log. We would extract product IDs and their query frequencies, then sort by ID, and run algorithms. I expect to see similar patterns: ternary search with adaptive splits (choosing splits based on cumulative probability) can outperform binary search for skewed data, especially when the skew is concentrated in a few keys. But building such adaptive splits requires knowing the distribution in advance (or online learning).

9. When Ternary Search Wins and When It Loses

9.1 Conditions Favorable for Ternary Search

  • The query distribution is highly skewed and the high-probability keys are clustered near one or both ends of the sorted array (so they can be placed as split points early).
  • The distribution allows the two split points at the root to capture two of the top keys, providing immediate low cost.

  • Branch misprediction: For skewed distribution, the branch prediction in ternary search can be highly accurate (since the most likely branch is known). Binary search might have approximately 50% misprediction rate in early steps. So ternary could be faster in CPU cycles even if it uses more comparisons.

  • Implementation complexity: Ternary search code is more complex, error-prone, and harder to maintain. The benefits must be significant to justify.

  • Adaptivity: If the distribution changes over time, we need to rebuild decision trees. Ternary tree building is more expensive than binary.

This can yield dramatically lower expected comparisons.

  3. For distributions with high-frequency keys scattered arbitrarily, optimal binary search tree (OBST) is a well-known solution with efficient O(n^2) construction. It typically provides close-to-optimal expected comparisons and is easier to implement than ternary trees.
