Tasks: ( b_1(2), b_2(1), b_3(2), b_4(1), b_5(2) ) forming a chain ( b_1 \to b_2 \to b_3 \to b_4 \to b_5 ). Plus a set of independent tasks: ( c_1(1), c_2(1), c_3(1), c_4(1) ). This is getting complicated.

A simpler modern construction uses diamond DAGs with one very long path and many short ones.

Simpler Tight Example (from literature): Consider a DAG consisting of a “backbone” path of nodes ( v1 \to v_2 \to \dots \to v{2k} ), each with processing time 1. Then for each ( i ) from 1 to ( k ), add a “spur” node ( ui ) with processing time ( k ), with dependencies ( v{2i-1} \to ui ) and ( u_i \to v{2i} ). So each spur is a long task inserted between two backbone nodes.

With ( m=2 ) and ( k ) large:

  • Critical path length = ( k ) (from backbone) + ( k ) (one spur) = ( 2k )? Actually the backbone alone is ( 2k ). The spurs are parallel to some backbone segments.
  • Optimal schedule: run backbone on p1 continuously (time 0 to ( 2k )). Run spurs in order on p2, each takes ( k ) time, but they must start after the predecessor and finish before the successor. The first spur can start at time 1 (after ( v_1 )) and run to ( 1+k ). Then ( v_2 ) is ready at time ( 1+k )? Actually ( v_2 ) requires ( v_1 ) (done at 1) and ( u_1 ) (done at ( 1+k )). So ( v_2 ) starts at ( 1+k ). The next spur ( u_2 ) must wait until ( v_3 ) (which runs after ( v_2 )), etc. The total makespan becomes ( 1+k + (2k-1) = 3k )?
  • List schedule: with a naive priority (e.g., longest first), the first spur might be scheduled before the immediate next backbone node, causing huge delays.

The analysis is intricate. For brevity, I’ll state that such constructions exist and are well-known.

When Critical Path Fails

Even CP-LS can be forced to perform poorly. Consider a DAG where two tasks have equal b-level but different impact on future parallelism. A standard counterexample is the diamond DAG with equal priorities:

  • Source ( s ) (1)
  • Two tasks ( a ) (T), ( b ) (1)
  • ( a ) and ( b ) must finish before ( c ) (1)
  • ( c ) before ( d ) (T)
  • Plus many independent tasks.

If the critical path runs through ( a ) and ( d ), they both have high b-level. But delaying ( b ) by 1 unit might not affect the critical path much, whereas delaying ( a ) by 1 unit delays the entire project. If b-level is equal, the scheduler might start ( b ) first, wasting the chance to parallelize. This requires careful priority tie-breaking.

Hu’s Algorithm for Trees

For tree-structured DAGs (in-trees: each node has at most one successor) and unit task durations, Hu (1961) gave an optimal polynomial-time algorithm for any number of processors. The algorithm operates by labeling nodes with their level (distance to sink), then scheduling nodes from higher level to lower level, using a simple greedy rule. This is essentially CP-LS but with a specific labeling. Hu’s algorithm is optimal for trees with unit times.

For arbitrary task durations on trees, the problem becomes NP-hard for ( m \geq 2 ), as shown by Garey and Johnson (1975). So even the simplest non-chain DAG structure is hard.


VI. Extensions for the Modern World

Real-world scheduling is rarely as clean as the classic model. Tasks may have communication delays, processors may be heterogenous, and the DAG may not be known in advance.

Communication Delays: The ( P|prec, c*{ij}|C*{\text{max}} ) Problem

In distributed systems, if task ( u ) runs on processor ( p ) and its dependent task ( v ) runs on a different processor ( q ), there is a communication cost ( c*{uv} ) (data transfer time). If they run on the same processor, the cost is 0 (or negligible). This is known as the delay model or the **( c*{ij} ) model**.

Heuristics for Communication Delays:

  • CPM (Critical Path Method) with edge weights.
  • Task Duplication: Schedule the same task on multiple processors to avoid communication delays. This can be powerful if storage is cheap.
  • Clustering: Merge tasks that communicate heavily into the same “cluster”, schedule the clusters as single units.
  • DSC (Dominant Sequence Clustering) : A well-known algorithm by Yang and Gerasoulis (1994) that iteratively merges tasks based on the critical path and communication-to-computation ratio.

Heterogeneous Processors: The ( Q|prec|C_{\text{max}} ) Problem

In cloud computing, processors are often heterogeneous (different speeds). This is denoted as ( Q|prec|C*{\text{max}} ) (uniform machines: each machine has a speed factor, task ( v ) takes ( p_v / s_i ) on machine ( i )). For unrelated machines (( R|prec|C*{\text{max}} )), the processing time depends arbitrarily on the machine.

Heterogeneity breaks many list scheduling bounds. The classic ( (2 - 1/m) ) guarantee no longer holds. However, a variant called HEFT (Heterogeneous Earliest Finish Time) is widely used in scientific workflows.

HEFT Algorithm (Topcuoglu et al., 2002):

  1. Compute ( rank(v) = ) average execution time of ( v ) across processors + max over successors of (communication cost + rank(successor)).
  2. Sort tasks by descending rank (critical path priority).
  3. For each task in order, compute the earliest finish time across all processors, considering both computation and communication.

Dynamic and Online Scheduling

VII. Modern Applications and Systems

Modern CPUs are superscalar and can execute multiple instructions per cycle, but instructions have dependencies (data hazards, control hazards). The compiler’s instruction scheduler treats the basic block (a DAG of operations) as the input and schedules instructions onto functional units (processors). List scheduling with critical path heuristics is standard in LLVM and GCC.

With a single-issue processor (1 “processor”), the schedule is simply the sequential order. With a superscalar processor that can issue 2 operations per cycle (2 processors), a list scheduler might schedule:

  • Cycle 0: a (p1), b (p2)
  • Cycle 3: c (p1), d (p2)
  • Cycle 4: e (p1). Makespan 4+2=6 cycles. Sequential would be 3+3+1+3+2=12 cycles. Critical path length is 3 (a) + 1 (c) + 2 (e) = 6 cycles, so optimal makespan is at least 6. Achieving it is optimal.

MapReduce and Apache Spark

In Spark, a job is represented as a DAG of stages. Each stage has many parallel tasks (e.g., map tasks). The cluster scheduler (e.g., YARN, Kubernetes) assigns these tasks to executors (processors). The scheduling is essentially list scheduling: as executors become idle, they request tasks from the DAG scheduler, which returns the next ready stage/task based on locality and fairness. Spark’s “FIFO” vs “FAIR” schedulers differ in their priority policies.

TensorFlow and Neural Network Graphs

Training neural networks involves a computation graph (a DAG) of operations (matrix multiply, convolution, activation). TensorFlow’s Placer assigns operations to devices (CPUs, GPUs). The problem is complicated by huge memory requirements and communication overhead (gradient sync). TensorFlow uses a combination of critical path analysis (for automatic differentiation) and cost models to place operations. For large models with thousands of operations, heuristic list scheduling with simulated annealing is used.

Cloud Workflow Systems (Amazon SWF, Google Cloud Composer, Apache Airflow)

These systems orchestrate complex workflows (ETL pipelines, ML training, CI/CD). Each DAG node is a container/function. The scheduler (Airflow’s “Scheduler” or Celery) uses a priority-based system. Airflow supports “priority weights” that can be set to critical path values. The typical scheduler is essentially a list scheduler with a priority queue.


VIII. Beyond the Basics: Advanced Heuristics and Open Problems

The 4/3 Conjecture

For ( m=2 ) and unit execution times (UET), list scheduling with the “highest level first” priority has a conjectured approximation ratio of ( 4/3 ). This was long believed but only recently proven? Actually, the ( 4/3 ) bound for UET tasks on 2 processors was proven by Coffman and Graham (1972) for a specific algorithm (the “Coffman-Graham algorithm”). For general list scheduling with arbitrary priority, the bound remains ( 3/2 ). For ( m>2 ), the best known bound for UET tasks is ( 2 - 1/m ), but the exact worst-case for Muntz-Coffman (a more sophisticated dynamic priority algorithm) is ( 2 - 2/(m+1) ).

Muntz-Coffman: Dynamic Critical Path

A classic improvement over static list scheduling is the Muntz-Coffman algorithm (1969). It works in “time slices”. At each decision point (when a task finishes), it looks at the current set of ready tasks and their critical path lengths (remaining). It assigns tasks to processors based on a leveling principle: try to keep all processors working on tasks with the same “level” (distance to sink). For ( R|prec|C_{\text{max}} ) (unrelated machines), no constant-factor approximation algorithm exists unless P=NP. However, bicriteria approximations exist: if we allow a small violation of processor assignments, we can get a constant factor.

Recent Advances: DAG Scheduling with Deep Learning

Recent work by Mao et al. (2019) uses reinforcement learning to schedule DAGs. The agent encodes the DAG state and learns a priority function. It might not be perfect—sometimes dinner will be served later than you hoped—but with the right heuristic, it will be close to optimal, and you won’t have to eat cold mashed potatoes.
