We also need to handle the accumulation of the tape. Currently, the tape is global and we never clear it. That would cause it to grow indefinitely across batches. We need to clear the tape after each backward pass (or after each forward). Actually, we should clear the tape at the start of each forward pass (or at the beginning of each batch). But note that the tape records operations as they happen. If we don’t clear, the tape will contain all operations from previous batches, which is not only wasteful but wrong because the gradient for those old operations doesn’t exist. We must ensure that each batch’s computational graph is independent. So we need to reset the tape before each batch.

We can integrate tape management into the training loop: at the beginning of a batch, we clear the tape. However, note that if we create tensors outside the batch (like the model parameters), those are not recorded on the tape because they are leaf tensors with _grad_fn=None. Only operations that produce new tensors are recorded. That’s fine. So we clear the tape at the start of each batch.

Now, the backward pass uses the tape. After the optimizer step, we can clear the tape again (already done at next batch start). To avoid accumulation across epochs, we clear at each batch start.

Now, we should test the code with a simple case to ensure gradients are computed correctly.


Verifying Gradients with Finite Differences

A vital step in building an AD system is verifying correctness. We can compare the gradients from our automatic differentiation against numerical gradients computed via finite differences. For a simple function, we can test.

Example: f(x,y) = x*y + sin(y). Compute gradient wrt x and y.

In‑place operations warning

In AD, in-place operations can break the computation graph because they modify data that might be needed for backward. Our framework currently does not support in-place modifications (e.g., p.data -= lr * grad is fine because we don’t rely on the old data after modification? Actually, after the backward pass, the gradient computation no longer needs the original values of weights because the backward pass is complete. However, if we wanted to use the weights again in a later forward pass, that’s fine because they have been updated. The key is that we should not modify a tensor’s data while the graph is still referencing it for backward. In our training loop, we do the backward pass first, then update weights. During the backward pass, the weights’ data are used in the forward computation (saved in the operation objects). After backward, those saved references are still there, but modifying the weight data in the optimizer does not affect the saved copies because they reference the tensor’s .data at the time of forward? Actually, we stored the weight tensor objects themselves in operations. In Add.forward(self, a, b), we store self.a = a, which is a reference to the tensor object. The tensor’s .data is a numpy array. If we later modifiy a.data (e.g., subtract gradient), that changes the data in-place. Does that affect the saved data? The saved a.data is the same numpy array reference. So when we later call backward, the saved a.data might have been changed. That is catastrophic: the backward pass expects the weights’ values as they were during forward. So we must avoid in-place modifications of weight data that are used in the forward graph. But the optimizer updates parameters after the backward pass is complete, so at that point the graph has already been used for backward. However, the operation objects still hold references to the tensors. If we then use the same model for the next forward pass, the tensor data will be updated. That’s fine because a new graph will be built. The potential problem is if we reuse the same tensor objects in multiple backward passes (we don’t, because after each batch we discard the graph). But careful: the weight tensors themselves are persistent across batches. At the start of a new batch, we clear the tape and build a new graph using those weight tensors. The new graph will capture the current values of the weights. The old graph is already gone because we cleared the tape (but the operation objects still exist? They are stored in the tape, and after we clear the tape, they are lost. However, the tensors’s _grad_fn still points to the old operation objects? In our implementation, each output tensor from an operation has a _grad_fn that points to the operation object. When we clear the tape, we only clear the list of operations; we do not destroy the operation objects. The tensors from the previous batch still hold references to their _grad_fn, which in turn hold references to input tensors (including weight tensors). That could cause memory leaks and also incorrect behavior if we ever call backward again on those old tensors. But in our training loop, we do not keep old tensors; we create new loss tensor each batch, and its gradient chain is fresh. However, the weight tensors are leaf tensors with _grad_fn=None, so they don’t hold references to old operations. The problem is with intermediate tensors: e.g., the hidden layer output from a previous batch is a tensor that we do not keep (it goes out of scope). So memory should be freed. But we need to ensure that we do not inadvertently keep references to old graphs. The safest approach is to detach the weight tensors from any old operation: after each backward pass, we could set _grad_fn = None on all tensors (except leaves), but that would break the graph for the current backward pass (which we already completed). Actually, after backward is done, we don’t need the graph. But the weight tensors are leaves and don’t have _grad_fn. For intermediate tensors, they go out of scope and get garbage collected. So it’s fine.

But there is a deeper issue: when we update the weight tensor’s .data in-place, if any operation object from a previous forward still holds a reference to that Tensor object, then modifying .data would affect that saved data. However, because we clear the tape, the operation objects from previous forward are only reachable from the tape list (which we empty). If no other references exist to those operation objects, they will be garbage collected. The tensors they reference (inputs) might still be referenced elsewhere (e.g., weight tensors). The weight tensor object is the same across batches. The operation object from a previous batch holds a reference to that weight tensor, but if the operation object is garbage collected, that reference disappears. However, if the operation object is not collected because it’s referenced by some other tensor’s _grad_fn, that could cause a leak. In our design, each output tensor has a _grad_fn that references the operation. Those output tensors are from previous batch and are not referenced (except maybe if we keep a list of losses). So they get collected. So in-place modification is safe as long as we do it after the backward pass and before the next forward pass. But we must ensure that we don’t hold any references to the old graph. We can also explicitly set _grad_fn = None on the output tensor after backward, but we don’t need to.

Nevertheless, to avoid any potential issues, many frameworks implement a backward graph that is ephemeral: after backward, the graph is automatically discarded. In PyTorch, the graph is freed after backward unless you specify retain_graph=True. Our framework simulates this by clearing the tape; but we should also disconnect the _grad_fn from tensors that are not needed. However, the leaf tensors (parameters) never had a _grad_fn. So they are fine.

Thus, our in-place update in the optimizer is safe.

Now, we can extend our framework with more operations (ReLU, tanh, etc.) and more layers (Conv, RNN) but that is beyond scope.


Beyond the Basics: Extensions and Gotchas

Let’s discuss some advanced topics and common pitfalls.

Custom Gradients

In PyTorch, you can define custom autograd functions by subclassing torch.autograd.Function. Our Function base class is a simplified version. You can also implement higher-order gradients by calling backward again.

Higher‑Order Gradients

To compute gradients of gradients (e.g., for Hessian‑vector products), you need the ability to backpropagate through the gradient computation itself. In our framework, the backward pass modifies .grad attributes but does not create new computational graph for the gradients. To support higher-order AD, we would need to make the backward pass differentiable. That is a major extension; JAX and PyTorch support it. Our toy does not.

Memory and Performance

Our tape stores every operation, which can be memory‑intensive. Modern frameworks fuse operations and use segmenting. Also, we use Python objects for each operation, which is slow. Production frameworks write C++ backends.

Handling Multiple Outputs

If we had a vector‑valued function, reverse mode would require separate backward passes for each output. However, we usually have a scalar loss.

Gradient Clipping

We can implement a function that modifies gradients in-place before the optimizer step.

Mixed Precision

Not covered.

Debugging with Hooks

We can add hooks to backward to print or store gradients.
