We also need to guard, for example, that a variable is still an integer if it could be changed by a call to an untyped function. In our subset, we assume no dynamic changes.

If a guard fails, we call a Python function that interprets the original bytecode (or raises TypeError). This is the deoptimization mechanism.

6. Advanced Topics

6.1 Inline Caching

Frequent type checks (e.g., for attribute access) can be optimized with inline caching. For Python, if we compile a function that accesses x.foo, we can cache the offset of foo in x’s class. On subsequent calls, we check a cache inline. This is done by PyPy and V8.

Our JIT doesn’t do attribute access, but if we extended it, we’d add polymorphic inline caches (PICs).

6.2 Tracing vs Method JIT

Our approach is a method JIT: we compile entire functions at once. Tracing JITs (like PyPy) compile only hot loops and fall back to interpreter for cold code. Method JITs have the advantage of better static analysis (whole function) but may compile cold code needlessly. Tracing JITs are more adaptive but have compilation overhead for traces.

Our minimal JIT is method-based. In practice, you’d combine both: compile method, but also profile loops and re-optimize.

6.3 Escape Analysis and Stack Allocation

Python objects are heap-allocated. In a JIT, if we can prove that an object doesn’t escape the function (e.g., a temporary tuple), we can allocate it on the stack or even scalarize it. This is a key optimization used by PyPy (virtualizable objects).

Our JIT operates on unboxed values, so we already avoid heap allocation for scalars. But for more complex objects, we’d need escape analysis.

7. Challenges and Pitfalls

7.1 Handling Arbitrary Python Objects

Our JIT only handles numeric types. Real Python uses strings, lists, dicts, and user-defined classes. Supporting all of them is extremely difficult. Numba and PyPy have dedicated object models. For a general-purpose JIT, you need to implement a virtual object system (e.g., Jython’s style or PyPy’s).

We chose a numeric subset because that’s where performance matters most for scientific computing. But if you need to JIT general Python, prepare for enormous complexity.

7.2 Exceptions and Stack Traces

When a JIT-compiled function raises an exception, we must ensure that the traceback includes Python source line info. That means mapping machine code positions back to bytecode offsets. We can capture this during code generation and store in a side table.

7.3 Debugging JITed Code

Debugging a function that has been transformed to machine code is painful. Tools like GDB can’t map back to Python source. Good JITs either provide a fallback interpreter for debugging or keep symbol info.

7.4 Portability

Our LLVM-based JIT is cross-platform by nature, but we used x86-64 specifics. LLVM abstracts target details. LLVM itself is portable (as long as you have an LLVM backend for your platform).

8. Performance Results and Analysis

Let’s benchmark our manual loop JIT against CPython and PyPy.

Our JIT gets very close to C speed because we eliminated all Python overhead (boxing, refcounting, dispatch). The small gap is due to LLVM’s optimization (which is as good as GCC/Clang for simple loops). This is impressive for a few hundred lines of Python code.

8.2 Particle Simulation

Recall the particle simulation from the introduction. We can write a JIT-compiled version:

If we represent particles as tuples of floats, our JIT can unbox and vectorize? Not yet, but we can hand-compile the inner loop with LLVM. Assuming we use arrays of structs, a JIT could achieve similar gains.

8.3 Comparison to Numba

Numba can compile the particle update with @njit and likely achieve the same performance as our manual JIT. The difference is Numba is production-ready, handles more types, has GPU support. Our JIT is educational.

9. Conclusions

9.1 Summary of Learnings

  • CPython is slow for tight numeric loops due to bytecode dispatching, boxing, and refcounting overheads.
  • Existing solutions like PyPy, Numba, and Cython offer speedups but come with trade-offs.
  • Building a minimal JIT compiler for a numeric subset of Python is feasible in a few hundred lines using LLVM.
  • The key insight is unboxing primitive values and generating native code, which can yield 50-100× speedups over CPython.
  • Challenges include handling dynamic types, deoptimization, and Python’s object model.

9.2 Future Directions

And remember: the next time you see the terminal cursor blink lazily while Python crawls, you now know how to make it run like C. Just build a JIT. Or use Numba. But building one is more fun.
